Structured Sparsity Optimization With Non-Convex Surrogates of l2,0-Norm: A Unified Algorithmic Framework

Xiaoqin Zhang et al.

Summary: In this article, a general optimization framework that uses structured sparsity to achieve superior recovery results is presented. The traditional method of solving structured sparse objectives using the L-2, L-1-norm as a convex surrogate often leads to large performance gaps. To address this issue, a framework that allows for a wide range of surrogate functions, including non-convex ones, is provided. A fixed point algorithm is also developed to solve a key non-convex structured sparse recovery optimization problem to global optimality with a guaranteed super-linear convergence rate. Three specific applications, outlier pursuit, supervised feature selection, and structured dictionary learning, are considered, and the optimization problem formulation and relaxation under a generic surrogate function are explained in detail. Extensive experiments on synthetic and real-world data demonstrate the effectiveness and efficiency of the proposed framework.
